Exploring and Applying Multimodal Models
Business scenario: Provide wealth advisors, customer service and risk control teams with unified image/audio/text capabilities, such as report interpretation, compliance review and intelligent quality inspection.
Executive concerns: model accuracy, data security, compute cost and operational efficiency.
Implementation advice: Focus on high-frequency use cases (ID document recognition, screenshot parsing and voice quality inspection), design human-in-the-loop workflows, and A/B test the key metrics.
Exploring and Applying Multimodal Models
In May 2024, I began exploring applications of multimodal models in depth, especially hands-on practice in image recognition and processing. Applying them in real projects gave me a much deeper understanding of multimodal technology.
What Is a Multimodal Model
A multimodal model is an AI model that can process multiple types of data at once (such as text, images and audio). Compared with single-modality models, multimodal models better understand and generate content that combines multiple kinds of information.
Models Explored
In practice, I focused mainly on the following families of multimodal models:
-
MiniCPM-V series
- A multimodal model based on Llama3
- Excellent image recognition performance
- Supports local deployment
-
CogVLM series
- A multimodal model developed by SenseTime
- Performs well on complex visual tasks
-
LLaVA series
- An open source vision-language model
- Active community support
Hands-on Practice
In the Descart project, I applied multimodal models to the following scenarios:
-
Image recognition
- Integrated the MiniCPM-V model
- Achieved accurate recognition of image content
- Supports text extraction from document images
-
ID document recognition
- Replaced traditional OCR technology
- Improved the accuracy of ID document recognition
- Reduced preprocessing steps
-
Content understanding
- Combined images and text for comprehensive analysis
- Improved the AI assistant's comprehension
Technical Implementation
On the implementation side, I adopted the following approaches:
-
Model deployment
- Used local deployment to avoid network latency
- Optimized model inference performance
- Designed sensible API interfaces
-
Service integration
- Wrapped multimodal capabilities as services
- Provided a unified calling interface
- Achieved seamless integration with existing systems
-
Performance optimization
- Model quantization to reduce resource consumption
- Batch processing to improve throughput
- Caching to reduce repeated computation
Application Scenarios
Through practice, I found multimodal models highly valuable in the following scenarios:
-
Intelligent assistants
- Understanding user needs from images
- Offering richer ways to interact
- Enhancing the user experience
-
Document processing
- Automatically extracting text information from images
- Understanding charts and structured content
- Generating structured data
-
Content creation
- Generating descriptive text from images
- Creating content that combines images and text
- Assisting design work
Technical Challenges
The hands-on work also brought some challenges:
-
Compute resources
- Multimodal models usually require more compute
- Relatively slow inference
- Large memory footprint
-
Model selection
- Different scenarios require different models
- Model quality and resource consumption must be balanced
- Frequent version updates
-
Data processing
- Preprocessing multimodal data is complex
- Alignment issues across modalities
- Data quality affects model performance
Optimization Strategies
To address these challenges, I adopted the following optimization strategies:
-
Model optimization
- Used quantization techniques to reduce resource consumption
- Adopted model pruning to improve inference speed
- Leveraged caching to reduce repeated computation
-
Architecture design
- Designed asynchronous processing mechanisms
- Implemented load balancing
- Adopted a microservice architecture to improve scalability
-
Resource management
- Allocated compute resources sensibly
- Implemented dynamic scaling up and down
- Monitored resource usage
Future Outlook
Multimodal technology is an important direction for AI; going forward, I plan to keep exploring in the following areas:
-
Model fusion
- Explore methods for fusing different models
- Build stronger multimodal understanding
-
Real-time processing
- Optimize model inference speed
- Enable real-time multimodal interaction
-
Expanding applications
- Explore more application scenarios
- Improve the user experience
A Manager's Action Checklist
- Prioritize scenarios: Focus on the scenarios with the greatest business impact (compliance review, operational quality inspection and customer insight), and define success metrics.
- Deploy security policies: Establish processes for collecting, anonymizing, storing and accessing multimodal data, ensuring compliance with regulations and internal corporate controls.
- Assess compute investment: Estimate GPU/edge device resource needs, and plan a resource strategy covering inference acceleration, batch processing and caching.
Summary
Multimodal models open up new possibilities for AI applications. By fusing images, text and other kinds of information, they enable smarter and more natural human-computer interaction. Although challenges remain in resource consumption and model selection, as the technology keeps maturing, multimodal models will surely play an important role in more and more fields.
